(1+ε)-approximate nearest neighbor search
The (1+ε)-approximate nearest neighbor search ((1+ε)-ANNS) problem addresses the curse of dimensionality by relaxing the exact nearest neighbor constraint. Given a metric space (M, d) and a query point q, the algorithm returns a point p whose distance to q is at most (1+ε) times the distance to the true optimal nearest neighbor p*. By trading a bounded, tunable error factor ε > 0 for exponential speedups, (1+ε)-ANNS enables sub-linear query times in high-dimensional vector spaces where exact search degenerates to linear scans.
HOW-TO IMPLEMENT & CONFIGURE
- Modern C++ compiler supporting C++17 or higher (GCC 9+, Clang 10+, MSVC 2019+)
- BLAS/LAPACK libraries (OpenBLAS or Intel MKL) for optimized matrix operations
- CMake 3.15+ build system
- Python 3.8+ with NumPy and pybind11 for evaluation harness bindings
Step 1
Initialize the project build structure, configure compiler optimization flags for SIMD vectorization (-O3 -march=native -mavx2 or -mavx512), and link memory-aligned allocators.
cmake_minimum_required(VERSION 3.15)
project(approx_nn_engine CXX)
set(CMAKE_CXX_STANDARD 17)
set(CMAKE_CXX_STANDARD_REQUIRED ON)
add_compile_options(-O3 -march=native -Wall -Wextra -pthread)
find_package(Threads REQUIRED)
add_library(ann_engine STATIC
src/metric.cpp
src/index.cpp
)
target_include_directories(ann_engine PUBLIC include)Step 2
Implement the core randomized kd-tree or proximity graph data structure ensuring distance bounds adhere strictly to the (1+ε) approximation threshold during traversal.
#include <vector>
#include <queue>
#include <cmath>
#include <limits>
#include <memory>
namespace ann {
class MetricSpace {
public:
virtual float distance(const std::vector<float>& a, const std::vector<float>& b) const = 0;
virtual ~MetricSpace() = default();
};
class EuclideanSpace : public MetricSpace {
public:
float distance(const std::vector<float>& a, const std::vector<float>& b) const override {
float sum = 0.0f;
for (size_t i = 0; i < a.size(); ++i) {
float diff = a[i] - b[i];
sum += diff * diff;
}
return std::sqrt(sum);
}
};
struct Candidate {
size_t id;
float dist;
bool operator>(const Candidate& other) const {
return dist > other.dist;
}
};
}
// End of core structural implementation header snippetStep 3
Construct a test harness validating that empirical recall against an exact linear scan meets the target threshold (e.g., Recall@1 >= 0.95) under parameter ε.
#include <cassert>
#include <iostream>
#include "ann/engine.hpp"
void test_epsilon_bound() {
ann::EuclideanSpace space;
std::vector<float> q = {0.0f, 0.0f};
std::vector<float> p_opt = {3.0f, 4.0f}; // Dist = 5.0
std::vector<float> p_approx = {3.1f, 4.1f}; // Dist approx 5.14
float d_opt = space.distance(q, p_opt);
float d_app = space.distance(q, p_approx);
float epsilon = 0.05f;
assert(d_app <= (1.0f + epsilon) * d_opt);
std::cout << "Verification passed: (1+epsilon) bound satisfied." << std::endl;
}
int main() {
test_epsilon_bound();
return 0;
}Step 4
Implement thread-safe query routing, handle memory-mapped index persistence for datasets exceeding RAM limits, and protect against catastrophic backtracking in degenerate clustering distributions.
#include <shared_mutex>
#include <vector>
namespace ann {
class ThreadSafeIndex {
private:
mutable std::shared_mutex mutex_;
std::vector<std::vector<float>> data_store_;
public:
void insert(const std::vector<float>& vector) {
std::unique_lock<std::shared_mutex> lock(mutex_);
data_store_.push_back(vector);
}
size_t size() const {
std::shared_lock<std::shared_mutex> lock(mutex_);
return data_store_.size();
}
};
}
// Production hardening prevents race conditions during concurrent index updates.
